Machine Learning for Network Intrusion Detection in Usa Critical Infrastructure: Challenges and Opportunities

Abstract
The convergence of information technology and operational technology in United States critical infrastructure has created unprecedented efficiency gains while simultaneously expanding attack surfaces vulnerable to sophisticated cyber threats. This paper examines the application of machine learning to network intrusion detection in critical infrastructure, with particular emphasis on smart cities and power grid implementations. Through comprehensive analysis of current threat landscapes, technical approaches, and operational constraints, the study identifies key challenges impeding the deployment of machine learning-based security solutions, including data scarcity, class imbalance, concept drift, and adversarial robustness concerns.
The analysis reveals that while machine learning offers promising capabilities for detecting anomalous patterns and previously unknown attack vectors beyond traditional signature-based systems, successful implementation requires addressing fundamental tensions between real-time operational requirements and computational complexity, between model explainability and detection accuracy, and between privacy preservation and effective security monitoring. The paper examines specific vulnerabilities in smart grid architectures, municipal systems, and IoT-enabled infrastructure, demonstrating how heterogeneous device ecosystems and legacy system integration compound security challenges.
Furthermore, the study synthesizes emerging opportunities including ensemble detection approaches, physics-informed machine learning, transfer learning techniques, federated learning, explainable artificial intelligence, and collaborative threat intelligence sharing mechanisms. It proposes a framework for crosssector collaboration and outlines standardized evaluation methodologies essential for validating machine learning security solutions in safety-critical environments. The findings indicate that realizing the full potential of machine learning for infrastructure protection requires coordinated efforts spanning technology development, workforce capacity building, regulatory framework evolution, and sustained information sharing across stakeholder communities. This work contributes to the growing body of knowledge on securing increasingly interconnected critical infrastructure systems upon which modern society fundamentally depends.

Advanced Graph Neural Network Mechanisms for IoT Network Intrusion Detection: A Comprehensive Study of Prototype-Based, Contrastive, and Structure Learning Approaches

Abstract
The proliferation of Internet of Things (IoT) devices has created unprecedented security challenges, with traditional intrusion detection systems struggling to achieve the accuracy needed for operational deployment. This comprehensive study investigates three advanced Graph Neural Network (GNN) mechanisms for network intrusion detection, addressing the fundamental limitations of standard edge-level classification approaches. We present Prototype-GNN, which leverages distance-based classification with learnable prototype embeddings; Contrastive-GNN, which optimizes embedding geometry through supervised contrastive learning; and GSL-GNN, which adaptively learns optimal graph structure from node features. Through extensive experimentation on the TON-IoT dataset containing 1 million network connections, we demonstrate that these mechanisms achieve 94.24%, 94.71%, and 96.66% accuracy respectively, representing substantial improvements of +2.37, +2.84, and +4.79 percentage points over the baseline EdgeLevelGCN (91.87%). Our best-performing GSL-GNN architecture achieves 99.70% ROC-AUC with an exceptionally low 1.5% false positive rate, addressing the critical challenge of alert fatigue in security operations. This journal article extends our preliminary conference study [1] by providing comprehensive ablation studies, additional architectural variants, and deeper theoretical analysis.

Optimized Naive Bayes for Phishing Website Detection using Hybrid TF - IDF and Character Level URL Features

Abstract
The rapid growth of phishing websites poses significant challenges to users and online systems, particularly as many existing detection approaches rely on webpage content analysis or computationally expensive deep learning models. This paper proposes a lightweight phishing URL detection method that integrates token-level Term Frequency–Inverse Document Frequency (TF–IDF) and character-level ngrams within a Multinomial Naive Bayes classifier. The proposed approach is evaluated on three public datasets, including the UCI Phishing Website dataset, PhishTank, and URLNet. Experimental results show that the model achieves F1-scores ranging from 0.904 to 0.940 when trained and tested on individual datasets, indicating robust detection performance. When the three datasets are merged for training, the model attains an F1-score of 0.931, with Recall improving by 2.0 percent compared to the average singledataset results, reflecting enhanced generalization across diverse data sources. The lightweight nature of the proposed method enables fast URL classification and practical deployment under hardware constraints.

Empirical Telemetry-based Metrics for Evaluating Honeypot Realism and Deception Effectiveness

Abstract
Honeypots remain critical tools for cyber deception, adversarial observation, and proactive threat intelligence. However, despite decades of development, the field still lacks a standardized and empirically validated framework for assessing deception effectiveness. Existing studies rely heavily on raw connection counts or ad hoc indicators, limiting reproducibility, comparability, and operational relevance. This paper presents a telemetry-driven methodology for evaluating honeypot realism and deception effectiveness across measurable behavioral dimensions. Using both a baseline cloud honeynet and an Enhanced Realism-Driven Honeynet (ERDH) modeled on a healthcare research environment, it's empirically demonstrated that domain-consistent realism significantly increases attacker dwell time, interaction depth, behavioral diversity, and malware family richness.
